The 50-year-old from nearby Torquay was pulled up by police over welfare concerns as he drove along McKillop Street early on Monday morning.
A weapon was found in the vehicle and the man ran from police, with officers giving chase.
But he then returned to the scene and allegedly stole their car.
It was recovered a short distance away, while the man barricaded himself inside a property.
Specialist units negotiated with the man, who was armed with knives, before he surrendered peacefully and was taken to hospital.
He is expected to be charged with theft of a motor vehicle and weapons offences on Monday.
